Critical move: we didn't try to replace existing maintenance scheduling. We added a layer on top. Maintenance leads still own the call. Stockouts and overstocks were both running high, with about $1.8M tied up in slow-movers. We built a forecasting layer pulling from their MES (Plex), ERP (NetSuite), and external signals (their top 5 customers' published lead-time changes from public filings and order patterns). The forecast updates weekly. The planner still owns the final call, but starts from a defensible baseline instead of a blank spreadsheet. Implementing AI on missing or unreliable data

A plant manager wants predictive maintenance but the machines don't have vibration or temperature sensors, or the sensors are there but the data isn't being captured anywhere queryable. The consultant either (a) walks away, (b) sells you a 6-month sensor installation project before the AI work even starts, or (c) ships a model trained on data that's too thin to be reliable, which then misses real failures and gets blamed on AI. The right answer is to be honest about the data baseline before scoping. If you have 6 months of clean MES history and decent uptime logs, we can do real work. If you have 3 weeks of partial data, we don't try to build forecasting on top of it. We fix the instrumentation first.

Industry 4.0 transformation theater instead of one solved problem

A consultant pitches a multi-phase digital transformation roadmap covering predictive maintenance, vision QC, scheduling, supply chain, and operator training, all integrated, all rolling out over 18 months for $1.2M. Two phases in, the budget is gone, nothing is in production, and the floor has lost faith. The right shape for mid-market manufacturing is the opposite: pick one problem, solve it inside 90 days, get a real number you can point to, then decide what to do next. Mid-market manufacturers don't have the IT depth to absorb a five-front transformation simultaneously. They do have the operating discipline to run one tight project at a time. Match the engagement to the operating model.

Custom-coded systems integrator builds with no exit

A traditional integrator quotes you a custom predictive maintenance system, hand-coded against your specific PLCs, with their team holding the keys. Two years later, the integrator has been acquired or the lead engineer left, and you're paying $180/hour for any changes because nobody internal can read the codebase. The fix: insist on standard tools (open-source ML frameworks, commodity cloud APIs, your data in your warehouse), insist on documentation that someone reasonable can read, and budget for a small in-house engineer or a low-key support retainer. AI work that creates a single point of failure in the form of one integrator is not really yours. It's leased.

When it does, it's usually a tightly scoped pilot: a 60-day predictive maintenance proof on one machine with existing sensor data, or a vision QC trial on one part type with existing inspection imagery. Includes data assessment (is your existing data good enough), a small working model, and a written go/no-go report for whether to scale. The deliverable is a decision, not a deployed system. Useful when leadership wants evidence before committing real budget.

Failure mode:Treating the pilot like the project. The pilot is supposed to inform the next decision, not run the line. If you stop here and try to operationalize a $20K pilot, it'll be brittle by month three.

Mid: $25K to $75K

Includes:Single-problem build, scoped to one production cell, one machine class, or one supplier docs intake workflow. Predictive maintenance on three to five connected machines with existing instrumentation. Vision QC on one inspection point, one part family, integrated with your line stop. Supplier docs intake (POs, COAs, packing lists) feeding your ERP automatically. Includes integration with one core system (your MES or your ERP, not both), 60-day pilot, and a 90-day support tail through ramp-up. This is the right starting point for most mid-market manufacturers.

Failure mode:Scoping across two systems on a first project. MES and ERP integration in the same scope doubles the political surface and the technical risk. Pick the system closest to the problem and ignore the other one until version two.

Strategic: $75K to $200K

$75K-$200K

Includes:Plant-wide build or multi-problem build for an established AI program. Predictive maintenance across an entire production line. Vision QC across multiple cells with shared model infrastructure. Demand forecasting connected to MES and ERP, with planner workflow integration. Includes formal data architecture design, integration with two or more core systems, governance (who owns model performance, who retrains, who escalates), training program for shop-floor operators and supervisors, and a 6-month support engagement that covers at least one quarter-close cycle and one model-retraining cycle.

Failure mode:Skipping the buy-in work with line workers and supervisors. Plant-wide AI that the floor doesn't trust will be quietly worked around within a quarter. Budget at least 15% of the project for change management, training, and visible wins early in the rollout.

Discovery

On-site visit if at all possible (no decent manufacturing AI gets scoped over Zoom). Walk the floor with the plant manager, COO, or maintenance lead. Look at the actual machines, the actual line, the actual paperwork. Pull a sample of MES and ERP data on the call. The goal: identify the one problem where the data is good enough, the operators are open enough, and the ROI is provable. We rule out problems where the data isn't there yet.

Scope Lock

Plain-English scope plus a data-readiness checklist (sensors needed, MES exports needed, ERP access needed, baseline period). Fixed price, fixed timeline, named deliverables tied to operating metrics (reduce unplanned downtime on machines X, Y, Z by a target percentage by date). Procurement and IT both get a copy. If your IT runs on SAP, NetSuite, Oracle, or Plex, we name the integration approach in the scope, not at build.

Design & Architecture

Two-week design phase. We pull the actual data, run baseline analysis, validate that the patterns we're targeting are real (not noise). Architecture decisions: where the model runs (edge vs. cloud), how data flows from PLC or MES to the model, where alerts surface (your existing CMMS, email, a small operator dashboard). We don't write production code until baseline analysis confirms the project is viable. This is also where we set the success metric: defect rate below X, downtime below Y, forecast accuracy above Z.

Build

Six to ten weeks for a mid-tier build. Weekly check-ins with the plant manager and the operating lead (maintenance super, QC manager, planner, depending on the use case). Pilot on one cell or one machine first. Real conditions, not staged tests. We expect to retrain the model at least once during pilot based on what the floor actually sees. If month two looks ugly, we kill, restart, or descope. We don't ship something brittle to save a deadline.

Handoff

Documentation that an internal engineer can pick up: model architecture, retraining procedure, alert thresholds, escalation path. Training for the operating team in their workflow, not a classroom. CMMS or dashboard configured to surface alerts where they already work. 90-day support window covering ramp-up. A named owner inside your organization, identified during scope lock, who'll run point on the system after I'm gone. If you don't have one, we recruit one as part of the engagement. The goal: the system runs without me by day 91.

Frequently asked questions

What's the realistic ROI on predictive maintenance?
Honest range, based on real engagements: 25% to 50% reduction in unplanned downtime on instrumented machines, with payback inside 12 to 18 months for mid-tier builds. The variation depends on three things: how much downtime you're starting with, how good your existing instrumentation is, and how disciplined your maintenance team is at acting on alerts. Plants with high baseline downtime and existing sensor coverage see the fastest payback. Plants with low baseline downtime see smaller absolute savings but often catch the catastrophic failure that justifies the whole investment in one event. I won't promise a specific percentage. I will work through your actual downtime numbers in discovery and tell you whether your situation supports the typical range or sits below it.
Will this integrate with our SAP / Oracle / NetSuite / Plex / Epicor?
Generally yes, with different integration approaches per system. SAP and Oracle ERP have well-documented APIs and middleware options (we usually pull through their standard reporting APIs or via a middleware layer like Boomi or MuleSoft if you already have one). NetSuite has clean REST APIs. Plex has an exposed API and decent export options. Epicor varies by version. The realistic approach: read-only integration first (pull data out, run analysis, push alerts back through email or CMMS), deeper write-back integration only after the model has earned trust. I won't propose a deep two-way integration on a first project. The risk-reward is wrong and your IT will rightfully push back. We start at the data layer, prove the model, then talk about deeper integration in version two.
We don't have great sensor data. Can we still do AI?
Depends on the use case. Predictive maintenance needs sensor data (vibration, temperature, current draw) or it doesn't work. If you don't have it, we either install sensors first (a separate project, often 8-12 weeks) or pick a different AI use case that doesn't depend on sensor data. Vision QC needs camera infrastructure and labeled examples but doesn't need machine sensors. Demand forecasting needs MES and ERP data, which most plants already have. Supplier docs intake needs no plant instrumentation at all, just access to your inbox or an SFTP folder. I'll be direct in discovery about which use cases are viable on your current data and which aren't. Building forecasting on three weeks of data, or maintenance on a machine with no instrumentation, is malpractice.
How does pilot vs. production actually work?
Pilot is the first 30 to 60 days on one machine, one cell, or one workflow. Pilot data is real but the operating decision authority sits with humans. The model recommends, the operator decides, and we track both signals: was the model right, and did the operator agree. End of pilot, we look at the numbers together and make a go/no-go on full deployment. Production means the system is integrated into the actual operating workflow (alerts go to the CMMS, vision QC stops the line, forecasting feeds the planner). I never recommend skipping the pilot. The cost of a bad production rollout (the floor losing trust in the system) is much higher than the cost of an extra 30 days of pilot. Plan for both phases up front, not as a surprise mid-project.
Who runs this system after the project ends?
Identified during scope lock, not at handoff. For most mid-market manufacturers, the right owner is a named engineer or analyst on your team (often a controls engineer, a continuous-improvement lead, or an IT generalist with curiosity about data). The handoff includes documentation they can read, retraining procedures they can run, and a 90-day support window where they shadow the system. If you genuinely don't have anyone to own it, we have a different conversation. Either we scope a small monthly retainer (usually $1,500-$4,000 depending on complexity), or we recommend hiring before the build kicks off. AI systems without a named owner decay. The model performance drifts, alerts get noisy, the floor stops trusting it, and within 18 months the project is dead.
How do you handle floor-worker buy-in?
Three things, in order. First, involve operators and supervisors during design, not after. The QC operator who's about to use a vision system has more useful input than any consultant. Second, frame the system as a tool that makes their job easier, not a replacement for their judgment. The model flags, they decide. We don't take humans out of the loop on safety-related or quality-critical calls. Third, ship a visible early win. If the system catches a real defect or flags a real bearing failure in week two, the floor's attitude shifts from skepticism to interest. If we're three months in with no visible wins, we have a different problem. The line worker buy-in question is the most underestimated risk in manufacturing AI projects.
What about Industry 4.0 and digital twin platforms?
Skeptical. The platforms exist, some are technically impressive, and a few mid-market manufacturers genuinely benefit from them. Most don't. Industry 4.0 platforms are usually multi-year, six- or seven-figure commitments that promise a fully integrated future state. Mid-market manufacturers without a dedicated Industry 4.0 program team can't operationalize them, and the platforms become expensive shelfware. My bias: solve one problem with focused AI work, get a real number, prove the value internally, then decide if a platform investment makes sense. If a vendor's pitch involves the phrase "digital transformation roadmap," ask them what specific operating metric improves in the first 90 days. If they can't answer in numbers, the platform isn't built for your size.
Do you do supply chain AI, or only plant-floor?
Both, with the caveat that supply chain AI projects in mid-market manufacturing are usually about demand forecasting and supplier docs intake, not the bigger SaaS-platform supply chain story. Demand forecasting is a clean fit when you have decent MES and ERP history (12+ months) and a planner who'll actually use a baseline forecast. Supplier docs intake (POs, COAs, packing lists, certs) is a near-universal win for plants buried in supplier paperwork, and the ROI on the AP and procurement teams is fast and obvious. What I don't do: end-to-end supply chain transformation projects. That's a different consultancy with different skills. If your problem is purely supply chain SaaS evaluation, I'll point you elsewhere.
How much of the build is AI vs. plumbing?
Honest answer: about 30% AI, 70% plumbing, integration, and operating workflow. The AI model itself is usually the easiest part of the project. The hard parts are getting clean data out of your MES, getting alerts into your CMMS, getting the QC operator to trust the vision system, and getting the planner to actually use the forecast. Consultants who pitch projects as 90% AI are either inexperienced or hiding the unsexy work that determines success. Mid-market manufacturing AI is operations engineering with a model in the middle. If you hire a pure data scientist for this work, the model will be excellent and the system will fail because nothing around the model is built right.
How do you train the floor on a new system?
On the floor, in their actual workflow, in 15-minute bursts. Classroom training for shop-floor operators almost always fails because the context is wrong (the operator can't connect a slide to the machine they run). What works: a printed one-page reference at the operator's station, a 5-minute walkthrough on shift, and a supervisor who's already been brought along during pilot. For maintenance teams, the training is usually slightly longer (20-30 minutes on the alert workflow plus the retraining basics) and benefits from being tied to a specific recent event the team remembers. For planners, training is closest to a desk job: a 60-minute working session walking through the forecast tool with their actual data. Different audience, different format. We design training as part of the build, not as an afterthought in week 12.
